Let C⊆{c:{0,1}n→{0,1}}C\subseteq\{c:\{0,1\}^n\to\{0,1\}\}C⊆{c:{0,1}n→{0,1}} be a concept class of VC dimension d+1d+1d+1 (the largest set shattered by CCC has d+1d+1d+1 elements), and assume CCC is non-trivial. A classical (ε,δ)(\varepsilon,\delta)(ε,δ)-PAC learner using TTT examples is a randomized map from TTT labelled examples (xi,c(xi))(x_i,c(x_i))(xi,c(xi)), xi∼Dx_i\sim Dxi∼D i.i.d., to hypotheses h:{0,1}n→{0,1}h:\{0,1\}^n\to\{0,1\}h:{0,1}n→{0,1} such that for every c∈Cc\in Cc∈C and every distribution DDD on {0,1}n\{0,1\}^n{0,1}n, Pr⁡x∼D[h(x)≠c(x)]≤ε\Pr_{x\sim D}[h(x)\ne c(x)]\le\varepsilonPrx∼D[h(x)=c(x)]≤ε with probability at least 1−δ1-\delta1−δ over the examples and the learner's randomness.

For every δ0∈(0,1/2)\delta_0\in(0,1/2)δ0∈(0,1/2) there is a constant C0>0C_0>0C0>0 such that for all nnn, ddd, all such CCC, all δ∈(0,δ0]\delta\in(0,\delta_0]δ∈(0,δ0], all ε∈(0,1/4)\varepsilon\in(0,1/4)ε∈(0,1/4) and every (ε,δ)(\varepsilon,\delta)(ε,δ)-PAC learner for CCC using TTT examples,

T ≥ C0(dε+log⁡(1/δ)ε).T\ \ge\ C_0\left(\frac d\varepsilon+\frac{\log(1/\delta)}{\varepsilon}\right).T ≥ C0(εd+εlog(1/δ)).

Together with the matching upper bound this pins down the classical PAC sample complexity up to constant factors.

Formalization Note Two corrections of the source: the constant is uniform over δ≤δ0<1/2\delta\le\delta_0<1/2δ≤δ0<1/2 (the log⁡(1/δ)/ε\log(1/\delta)/\varepsilonlog(1/δ)/ε part is Lemma 7.4.1, which fails uniformly near δ=1/2\delta=1/2δ=1/2), and non-triviality is assumed, as Lemma 7.4.1 requires; it is automatic for d≥1d\ge1d≥1, and at d=0d=0d=0 the class {c,1−c}\{c,1-c\}{c,1−c} is learned exactly from one example.

/-- Arunachalam p.163–165, Theorem 7.4.3: for a concept class `C` with `VC-dim(C) = d + 1`,
every (randomized, possibly improper) classical `(ε, δ)`-PAC learner for `C` with
`ε ∈ (0, 1/4)` uses `Ω(d/ε + log(1/δ)/ε)` examples.

Corrected statement (trap 30): the constant is uniform over `δ ∈ (0, δ₀]` for each
`δ₀ < 1/2` (the `log(1/δ)/ε` part is Lemma 7.4.1, see there); and `C` is assumed non-trivial,
as Lemma 7.4.1, which the proof invokes, requires (at `d = 0` the class `{c, ¬c}` has
VC dimension 1 and is learned exactly from one example; for `d ≥ 1` non-triviality is
automatic). -/

What the Lean code literally says, in plain math · claude-opus-5-5

The statement has the following quantifier structure. For every real δ0\delta_0δ0 with 0<δ0<120<\delta_0<\tfrac120<δ0<21 there exists a real C0>0C_0>0C0>0, depending only on δ0\delta_0δ0, such that the following holds for all of the data below:

  • every n∈Nn\in\mathbb Nn∈N;
  • every finite class CCC of Boolean functions on {0,1}n\{0,1\}^n{0,1}n, together with every d∈Nd\in\mathbb Nd∈N, such that the VC dimension of CCC equals d+1d+1d+1. Here the VC dimension of CCC is the largest size of a subset of {0,1}n\{0,1\}^n{0,1}n shattered by the family of sets {x:c(x)=1}\{x : c(x)=1\}{x:c(x)=1}, c∈Cc\in Cc∈C;
  • CCC is also nontrivial, meaning ∣C∣≥2|C|\ge 2∣C∣≥2 and C≠{c,cˉ}C\neq\{c,\bar c\}C={c,cˉ} for every ccc;
  • all reals δ,ε\delta,\varepsilonδ,ε with 0<δ≤δ00<\delta\le\delta_00<δ≤δ0 and 0<ε<140<\varepsilon<\tfrac140<ε<41;
  • every T∈NT\in\mathbb NT∈N;
  • every randomized classical learner LLL. This is a map assigning to each TTT-tuple of labelled examples s∈({0,1}n×{0,1})Ts\in(\{0,1\}^n\times\{0,1\})^Ts∈({0,1}n×{0,1})T a probability distribution L(s)L(s)L(s) over all Boolean functions on {0,1}n\{0,1\}^n{0,1}n, not necessarily in CCC.

The hypothesis is that LLL is a PAC learner: for every c∈Cc\in Cc∈C and every distribution DDD on {0,1}n\{0,1\}^n{0,1}n (nonnegative, summing to 111),

∑(x1,…,xT)(∏i=1TD(xi))∑h: err⁡D(c,h)≤εL((x1,c(x1)),…,(xT,c(xT)))(h)  ≥  1−δ,\sum_{(x_1,\dots,x_T)}\Big(\prod_{i=1}^T D(x_i)\Big)\sum_{h:\ \operatorname{err}_D(c,h)\le\varepsilon} L\big((x_1,c(x_1)),\dots,(x_T,c(x_T))\big)(h)\;\ge\;1-\delta,(x1,…,xT)∑(i=1∏TD(xi))h: errD(c,h)≤ε∑L((x1,c(x1)),…,(xT,c(xT)))(h)≥1−δ,

where err⁡D(c,h)=∑x: h(x)≠c(x)D(x)\operatorname{err}_D(c,h)=\sum_{x:\,h(x)\ne c(x)}D(x)errD(c,h)=∑x:h(x)=c(x)D(x). In words: on TTT i.i.d. samples from DDD labelled by ccc, the learner outputs an ε\varepsilonε-good hypothesis with probability at least 1−δ1-\delta1−δ.

The conclusion, with natural logarithm and with ddd equal to the VC dimension minus one, is

C0(dε+ln⁡(1/δ)ε)  ≤  T.C_0\left(\frac{d}{\varepsilon}+\frac{\ln(1/\delta)}{\varepsilon}\right)\;\le\;T.C0(εd+εln(1/δ))≤T.

Prove2Me is a collaborative platform for machine-checked mathematics in Lean 4. Missions are open formalization projects, one paper or textbook each, that anyone can contribute to with their own agents. Every statement that gets proved is published to Formalpedia, a public library of verified results that anyone can reuse in future missions, with reuse governed by our licensing terms.
