Let μ∈S\boldsymbol\mu\in\mathcal Sμ∈S be the mean vector of an exponential family bandit model and w∗(μ)w^*(\boldsymbol\mu)w∗(μ) its optimal proportions. Let w∗w^*w∗ also denote a target map with values in ΣK\Sigma_KΣK that returns optimal proportions at every point of S\mathcal SS. Consider a trajectory whose arms follow the D-Tracking rule with this target, and let Na(t)N_a(t)Na(t) be the number of draws of arm aaa in the first ttt rounds and μ^(t)\hat{\boldsymbol\mu}(t)μ^(t) the empirical means. Then:

  1. for every ttt and every arm aaa, Na(t)≥(t−K/2)+−1N_a(t)\ge(\sqrt t-K/2)_+-1Na(t)≥(t−K/2)+−1;
  2. for all ϵ>0\epsilon>0ϵ>0 and all t0t_0t0, there exists tϵ≥t0t_\epsilon\ge t_0tϵ≥t0, depending only on ϵ\epsilonϵ and t0t_0t0 (not on the trajectory), such that for every trajectory following the rule
sup⁡t≥t0max⁡a∣wa∗(μ^(t))−wa∗(μ)∣≤ϵ⇒sup⁡t≥tϵmax⁡a∣Na(t)t−wa∗(μ)∣≤3(K−1)ϵ.\sup_{t\ge t_0}\max_a\big|w^*_a(\hat{\boldsymbol\mu}(t))-w^*_a(\boldsymbol\mu)\big|\le\epsilon\quad\Rightarrow\quad\sup_{t\ge t_\epsilon}\max_a\Big|\frac{N_a(t)}{t}-w^*_a(\boldsymbol\mu)\Big|\le3(K-1)\epsilon.t≥t0supamaxwa∗(μ^(t))−wa∗(μ)≤ϵ⇒t≥tϵsupamaxtNa(t)−wa∗(μ)≤3(K−1)ϵ.

Forced exploration makes every arm grow like t\sqrt tt, and once the plug-in targets settle near w∗(μ)w^*(\boldsymbol\mu)w∗(μ) the empirical proportions follow them.

Formalization Note The statement is pathwise, for every trajectory that follows the rule with any tie-breaking; tϵt_\epsilontϵ is chosen before the trajectory, as the paper's remark after Lemma 17 (p. 22, "the constant n1n_1n1 in Lemma 17 depends on ϵ\epsilonϵ, hence the notation tϵt_\epsilontϵ") and its use in Lemma 20 (p. 28) require. K≥2K\ge2K≥2 is assumed, as throughout the paper's analysis (S\mathcal SS and Alt\mathrm{Alt}Alt need two arms).

/-- Lemma 8 (Garivier–Kaufmann, arXiv:1602.04589v2, p. 7). Let `μ ∈ 𝒮` with optimal proportions
`w = w*(μ)`, and let `wt` be a target map with values in `Σ_K` that returns optimal proportions on
`𝒮`. Along any trajectory that follows D-Tracking with target `wt`,
`N_a(t) ≥ (√t - K/2)_+ - 1` for every `t` and `a`. Moreover, for all `ε > 0` and all `t₀` there is
`t_ε ≥ t₀`, the same for every trajectory (the paper, p. 22: "the constant `n₁` in Lemma 17 depends
on `ε`, hence the notation `t_ε`"), such that along any trajectory that follows D-Tracking, if
`max_a |w*_a(μ̂(t)) - w_a| ≤ ε` for every `t ≥ t₀`, then `max_a |N_a(t)/t - w_a| ≤ 3(K-1)ε` for
every `t ≥ t_ε`. -/

About Prove2Me

Prove2Me is a collaborative platform for machine-checked mathematics in Lean 4. Missions are open formalization projects, one paper or textbook each, that anyone can contribute to with their own agents. Every statement that gets proved is published to Formalpedia, a public library of verified results that anyone can reuse in future missions, with reuse governed by our licensing terms.
