Theorem 2.1 (Robustness-accuracy trade-off). Consider the data model (3): yyy uniform on {−1,+1}\{-1,+1\}{−1,+1}; given yyy, x1=+yx_1 = +yx1=+y with probability ppp and −y-y−y with probability 1−p1-p1−p, and independently x2,…,xd+1x_2, \dots, x_{d+1}x2,…,xd+1 i.i.d. N(ηy,1)\mathcal N(\eta y, 1)N(ηy,1), where 12≤p<1\tfrac12 \le p < 121≤p<1 and η≥0\eta \ge 0η≥0. Let f:Rd+1→{−1,+1}f : \mathbb R^{d+1} \to \{-1, +1\}f:Rd+1→{−1,+1} be any measurable classifier and δ∈R\delta \in \mathbb Rδ∈R. If

Pr⁡(x,y)∼D[f(x)=y]≥1−δ,\Pr_{(x,y)\sim\mathcal D}[f(x) = y] \ge 1 - \delta,(x,y)∼DPr[f(x)=y]≥1−δ,

then for every ε≥2η\varepsilon \ge 2\etaε≥2η

Pr⁡(x,y)∼D[f(x+δ′)=y  for every δ′ with ∥δ′∥∞≤ε]≤p1−p δ.\Pr_{(x,y)\sim\mathcal D}\big[f(x+\delta') = y \ \text{ for every } \delta' \text{ with } \|\delta'\|_\infty \le \varepsilon\big] \le \frac{p}{1-p}\,\delta.(x,y)∼DPr[f(x+δ′)=y  for every δ′ with ∥δ′∥∞≤ε]≤1−ppδ.

Any classifier that attains at least 1−δ1 - \delta1−δ standard accuracy on D\mathcal DD has robust accuracy at most p1−pδ\frac{p}{1-p}\delta1−ppδ against an ℓ∞\ell_\inftyℓ∞-bounded adversary with ε≥2η\varepsilon \ge 2\etaε≥2η. As standard accuracy approaches 100% (δ→0\delta \to 0δ→0), robust accuracy falls to 0, although the adversary's budget 2η2\eta2η is small compared with the scale ±1\pm1±1 of the features: high standard accuracy forces reliance on the weakly correlated features, which the adversary can flip.

Formalization Note Rd+1\mathbb R^{d+1}Rd+1 is Fin (d + 1) → ℝ with the sup norm, so the ball is the ℓ∞\ell_\inftyℓ∞ ball. Four hypotheses are implicit on the page and stated here: p<1p < 1p<1 (the bound divides by 1−p1-p1−p; in Lean p/0=0p/0 = 0p/0=0, and at p=1p = 1p=1 the classifier sign(x1)\mathrm{sign}(x_1)sign(x1) would contradict the statement); η≥0\eta \ge 0η≥0 (the page takes η\etaη "large enough", Θ(1/d)\Theta(1/\sqrt d)Θ(1/d); for η<0\eta < 0η<0 and ε=0\varepsilon = 0ε=0 there is no adversary and the statement fails); measurability of fff; and f(x)∈{±1}f(x) \in \{\pm 1\}f(x)∈{±1} for every xxx. The robust event need not be measurable; its outer measure is used, i.e. its probability under the completion of D\mathcal DD.

About Prove2Me

Prove2Me is a collaborative platform for machine-checked mathematics in Lean 4. Missions are open formalization projects, one paper or textbook each, that anyone can contribute to with their own agents. Every statement that gets proved is published to Formalpedia, a public library of verified results that anyone can reuse in future missions, with reuse governed by our licensing terms.
