Let (Xi,Yi)(X_i,Y_i)(Xi,Yi), i=1,…,ni=1,\dots,ni=1,…,n (n≥1n\ge1n≥1), follow the trace regression model

E(Yi∣Xi)=⟨A0,Xi⟩=tr⁡(Xi⊤A0),\mathbb E(Y_i\mid X_i)=\langle A_0,X_i\rangle=\operatorname{tr}(X_i^\top A_0),E(Yi∣Xi)=⟨A0,Xi⟩=tr(Xi⊤A0),

where XiX_iXi are random real m1×m2m_1\times m_2m1×m2 matrices with square-integrable entries, YiY_iYi are integrable real random variables with Yi(Xi)jkY_i(X_i)_{jk}Yi(Xi)jk integrable, and A0A_0A0 is a fixed matrix. Let A\mathbb AA be a set of m1×m2m_1\times m_2m1×m2 matrices and λ>0\lambda>0λ>0. Fix a realization of the sample and let A^λ\hat A^\lambdaA^λ be a minimizer over A\mathbb AA of

Ln(A)=∥A∥L2(Π)2−⟨2n∑i=1nYiXi,A⟩+λ∥A∥1,L_n(A)=\|A\|^2_{L_2(\Pi)}-\Big\langle\frac2n\sum_{i=1}^nY_iX_i,A\Big\rangle+\lambda\|A\|_1,Ln(A)=∥A∥L2(Π)2−⟨n2i=1∑nYiXi,A⟩+λ∥A∥1,

where ∥A∥L2(Π)2=1n∑iE⟨A,Xi⟩2\|A\|^2_{L_2(\Pi)}=\frac1n\sum_i\mathbb E\langle A,X_i\rangle^2∥A∥L2(Π)2=n1∑iE⟨A,Xi⟩2 and ∥⋅∥1\|\cdot\|_1∥⋅∥1 is the nuclear norm. Let M=1n∑i=1n(YiXi−E(YiXi))\mathbf M=\frac1n\sum_{i=1}^n(Y_iX_i-\mathbb E(Y_iX_i))M=n1∑i=1n(YiXi−E(YiXi)) and suppose λ≥2∥M∥∞\lambda\ge2\|\mathbf M\|_\inftyλ≥2∥M∥∞ (operator norm). Then:

  1. for any set A\mathbb AA,
∥A^λ−A0∥L2(Π)2≤inf⁡A∈A[∥A−A0∥L2(Π)2+2λ∥A∥1];(2.3)\|\hat A^\lambda-A_0\|^2_{L_2(\Pi)}\le\inf_{A\in\mathbb A}\Big[\|A-A_0\|^2_{L_2(\Pi)}+2\lambda\|A\|_1\Big];\qquad(2.3)∥A^λ−A0∥L2(Π)2≤A∈Ainf[∥A−A0∥L2(Π)2+2λ∥A∥1];(2.3)
  1. if, in addition, A\mathbb AA is convex and Assumption 1 holds with a constant μ>0\mu>0μ>0 (that is, ∥D∥L2(Π)2≥μ−2∥D∥22\|D\|^2_{L_2(\Pi)}\ge\mu^{-2}\|D\|_2^2∥D∥L2(Π)2≥μ−2∥D∥22 for all D∈A−AD\in\mathbb A-\mathbb AD∈A−A), then
∥A^λ−A0∥L2(Π)2≤inf⁡A∈A[∥A−A0∥L2(Π)2+(1+22)2μ2λ2rank⁡(A)];(2.4)\|\hat A^\lambda-A_0\|^2_{L_2(\Pi)}\le\inf_{A\in\mathbb A}\Big[\|A-A_0\|^2_{L_2(\Pi)}+\Big(\frac{1+\sqrt2}{2}\Big)^2\mu^2\lambda^2\operatorname{rank}(A)\Big];\qquad(2.4)∥A^λ−A0∥L2(Π)2≤A∈Ainf[∥A−A0∥L2(Π)2+(21+2)2μ2λ2rank(A)];(2.4)
  1. in this case, for every A∈AA\in\mathbb AA∈A with support (S1,S2)(S_1,S_2)(S1,S2),
∥A^λ−A0∥L2(Π)2+(λ−2∥M∥∞)∥PS1⊥A^λPS2⊥∥1≤∥A−A0∥L2(Π)2+(1+22)2μ2λ2rank⁡(A).(2.5)\|\hat A^\lambda-A_0\|^2_{L_2(\Pi)}+(\lambda-2\|\mathbf M\|_\infty)\|P_{S_1^\perp}\hat A^\lambda P_{S_2^\perp}\|_1\le\|A-A_0\|^2_{L_2(\Pi)}+\Big(\frac{1+\sqrt2}{2}\Big)^2\mu^2\lambda^2\operatorname{rank}(A).\qquad(2.5)∥A^λ−A0∥L2(Π)2+(λ−2∥M∥∞)∥PS1⊥A^λPS2⊥∥1≤∥A−A0∥L2(Π)2+(21+2)2μ2λ2rank(A).(2.5)

These are sharp oracle inequalities: the leading constant in front of the approximation error ∥A−A0∥L2(Π)2\|A-A_0\|^2_{L_2(\Pi)}∥A−A0∥L2(Π)2 is 111. The first is the "slow rate" bound in terms of the nuclear norm of the oracle, the second the "fast rate" bound in terms of its rank. Every later upper bound of the paper (matrix completion, Theorem 4) is obtained by bounding ∥M∥∞\|\mathbf M\|_\infty∥M∥∞ in probability and applying this theorem.

Formalization Note The statement is realization-wise: it holds for every sample point at which A^λ\hat A^\lambdaA^λ is a minimizer and λ≥2∥M∥∞\lambda\ge2\|\mathbf M\|_\inftyλ≥2∥M∥∞. Each infimum is stated as the bound for every A∈AA\in\mathbb AA∈A (equivalent). The model (1.1) is the conditional expectation of YiY_iYi given the σ\sigmaσ-algebra of the entries of XiX_iXi. The integrability and measurability conditions are not printed in the paper; they make the expectations meaningful. Independence of the pairs is not assumed (the proof does not use it). The support (S1,S2)(S_1,S_2)(S1,S2) is given by SVD data S : SVD A r, and PS1⊥A^λPS2⊥P_{S_1^\perp}\hat A^\lambda P_{S_2^\perp}PS1⊥A^λPS2⊥ is normalProjection S Ahat.
