Let J:Rm→RJ : \mathbb{R}^m \to \mathbb{R}J:Rm→R be twice continuously differentiable and uniformly convex, satisfying (4.2):

λ∥d∥22≤dT∇2J(w) d≤L∥d∥22for all w,d,\lambda\|d\|_2^2 \le d^T\nabla^2 J(w)\,d \le L\|d\|_2^2 \qquad\text{for all } w, d,λ∥d∥22≤dT∇2J(w)d≤L∥d∥22for all w,d,

with constants 0<λ<L0<\lambda<L0<λ<L. Let w∗w_*w∗ be its minimizer and assume J(w∗)=0J(w_*) = 0J(w∗)=0. Let θ∈(0,1)\theta \in (0,1)θ∈(0,1), let (gk)k≥0(g_k)_{k \ge 0}(gk)k≥0 be arbitrary vectors (approximations to ∇J(wk)\nabla J(w_k)∇J(wk)), and let {wk}\{w_k\}{wk} be generated by iteration (4.1) with the steplength (4.7),

wk+1=wk−αgk,α=1−θL.w_{k+1} = w_k - \alpha g_k, \qquad \alpha = \frac{1-\theta}{L}.wk+1=wk−αgk,α=L1−θ.

Put β=(1−θ)22(1+θ)2\beta = \dfrac{(1-\theta)^2}{2(1+\theta)^2}β=2(1+θ)2(1−θ)2. Then:

  1. (4.9) If at an iteration kkk the approximate gradient satisfies (4.8), ∥gk−∇J(wk)∥≤θ∥gk∥\|g_k - \nabla J(w_k)\| \le \theta\|g_k\|∥gk−∇J(wk)∥≤θ∥gk∥, then
J(wk+1)≤(1−βλL)J(wk).J(w_{k+1}) \le \Bigl(1 - \frac{\beta\lambda}{L}\Bigr) J(w_k).J(wk+1)≤(1−Lβλ)J(wk).

If moreover (4.8) holds at every iteration, then:

  1. (4.10) wk→w∗w_k \to w_*wk→w∗.
  2. (4.11) For every ϵ>0\epsilon > 0ϵ>0, every iteration count kkk with
k>Lβλ[log⁡(1/ϵ)+log⁡J(w0)]k > \frac{L}{\beta\lambda}\bigl[\log(1/\epsilon) + \log J(w_0)\bigr]k>βλL[log(1/ϵ)+logJ(w0)]

satisfies J(wk)<ϵ=J(w∗)+ϵJ(w_k) < \epsilon = J(w_*) + \epsilonJ(wk)<ϵ=J(w∗)+ϵ; that is, the number of iterations needed to reach J(wj)≤J(w∗)+ϵJ(w_j) \le J(w_*) + \epsilonJ(wj)≤J(w∗)+ϵ is at most Lβλ[log⁡(1/ϵ)+log⁡J(w0)]\frac{L}{\beta\lambda}[\log(1/\epsilon) + \log J(w_0)]βλL[log(1/ϵ)+logJ(w0)]. 4. (4.12) For every kkk,

∥gk∥2≤1(1−θ)2 2L2J(w0)λ(1−βλL)k.\|g_k\|^2 \le \frac{1}{(1-\theta)^2}\,\frac{2L^2 J(w_0)}{\lambda}\Bigl(1 - \frac{\beta\lambda}{L}\Bigr)^k.∥gk∥2≤(1−θ)21λ2L2J(w0)(1−Lβλ)k.

The theorem shows that a gradient approximation whose error is at most a fixed fraction θ\thetaθ of its own norm preserves the linear convergence rate of steepest descent, at the price of the factor β\betaβ. It motivates the sample-size rule of the stochastic analysis in §4.2.

Formalization Note The space is EuclideanSpace ℝ (Fin m), lam is the paper's λ\lambdaλ, and assumption (4.2) is HessianBounds J lam L. The minimizer is a point w∗w_*w∗ with J(w∗)≤J(w)J(w_*) \le J(w)J(w∗)≤J(w) for all www, and J(w∗)=0J(w_*) = 0J(w∗)=0 is a hypothesis. (4.11) is stated in the form the proof establishes ((4.18), p. 10): every kkk beyond the bound is ϵ\epsilonϵ-accurate; log⁡\loglog is the natural logarithm. If J(w0)=0J(w_0) = 0J(w0)=0 Lean's convention log⁡0=0\log 0 = 0log0=0 applies, and the statement remains true because then every iterate is optimal.

About Prove2Me

Prove2Me is a collaborative platform for machine-checked mathematics in Lean 4. Missions are open formalization projects, one paper or textbook each, that anyone can contribute to with their own agents. Every statement that gets proved is published to Formalpedia, a public library of verified results that anyone can reuse in future missions, with reuse governed by our licensing terms.
