Consider an nnn-player game with n≥2n\ge2n≥2 in which every player has ddd strategies and utilities ui(s)∈[0,1]u_i(s)\in[0,1]ui(s)∈[0,1]. Each player iii has a regularizer Ri\mathcal R_iRi that is 1-strongly convex with respect to ∥⋅∥1\|\cdot\|_1∥⋅∥1 on the simplex Δ\DeltaΔ, and RRR bounds every range: Ri(f)−Ri(g)≤R\mathcal R_i(f)-\mathcal R_i(g)\le RRi(f)−Ri(g)≤R for all iii and all f,g∈Δf,g\in\Deltaf,g∈Δ. Fix a horizon T≥1T\ge1T≥1 and the step size

η=(n−1)−1/2 T−1/4.\eta=(n-1)^{-1/2}\,T^{-1/4}.η=(n−1)−1/2T−1/4.

Suppose the game is played repeatedly and every player runs optimistic FTRL with regularizer Ri\mathcal R_iRi, step size η\etaη and one-step recency bias Mit=uit−1M_i^t=u_i^{t-1}Mit=uit−1, where uitu_i^tuit is player iii's utility vector against the profile wtw^twt played at time ttt. Then for every player iii and every fixed strategy wi∗∈Δw_i^*\in\Deltawi∗∈Δ,

∑t=1T⟨wi∗−wit,uit⟩≤(R+4)n−1⋅T1/4.\sum_{t=1}^T\langle w_i^*-w_i^t,u_i^t\rangle\le(R+4)\sqrt{n-1}\cdot T^{1/4}.t=1∑T⟨wi∗−wit,uit⟩≤(R+4)n−1⋅T1/4.

Each player's regret thus grows like T1/4T^{1/4}T1/4, so its average regret decays like T−3/4T^{-3/4}T−3/4, against the T−1/2T^{-1/2}T−1/2 rate that holds against an adversary. It is the paper's result on the convergence of individual utilities.

Formalization Note The conditions n≥2n\ge2n≥2 and T≥1T\ge1T≥1 are added because the step size is undefined otherwise. The paper's R=max⁡i(sup⁡ΔRi−inf⁡ΔRi)R=\max_i(\sup_\Delta\mathcal R_i-\inf_\Delta\mathcal R_i)R=maxi(supΔRi−infΔRi) is replaced by any common upper bound on the ranges, which includes the exact value. The regret ri(T)=sup⁡w∗∑t⟨w∗−wit,uit⟩r_i(T)=\sup_{w^*}\sum_t\langle w^*-w_i^t,u_i^t\rangleri(T)=supw∗∑t⟨w∗−wit,uit⟩ is bounded through every comparator w∗∈Δw^*\in\Deltaw∗∈Δ. The statement covers every run of the dynamics, and the vector ui0u_i^0ui0 entering Mi1M_i^1Mi1 is the utility vector against w0w^0w0. The horizon TTT is fixed before play, because η\etaη depends on it.
