(Phased elimination with G-optimal design — Theorem 22.1) There is a universal constant C>0C>0C>0 such that for every fixed action set of kkk arms in Rd\mathbb{R}^dRd, horizon n≥2n \ge 2n≥2 and δ∈(0,1)\delta \in (0,1)δ∈(0,1) there is a policy π\piπ (Algorithm 12: phased elimination with G-optimal exploration) such that on every linear bandit instance with gaps Δa≤1\Delta_a \le 1Δa≤1: with probability at least 1−δ1-\delta1−δ, the random regret satisfies

∑aTa(n)Δa≤Cndlog⁡(klog⁡(n)/δ);\sum_a T_a(n)\Delta_a \le C\sqrt{nd\log(k\log(n)/\delta)};a∑Ta(n)Δa≤Cndlog(klog(n)/δ);

and if δ=1/n\delta = 1/nδ=1/n, the expected regret satisfies

Rn≤Cndlog⁡(kn).R_n \le C\sqrt{nd\log(kn)}.Rn≤Cndlog(kn).

Setup and notation. This is an existence statement about kkk-armed stochastic bandits with linear structure. A kkk-armed bandit ν\nuν is a kkk-tuple of probability measures νj\nu_jνj on R\mathbb{R}R with means μj=∫r dνj(r)\mu_j = \int r\, d\nu_j(r)μj=∫rdνj(r), optimal mean μ∗=max⁡jμj\mu^* = \max_j \mu_jμ∗=maxjμj, and gaps Δj=μ∗−μj\Delta_j = \mu^* - \mu_jΔj=μ∗−μj. A policy π\piπ is a family of Markov kernels from histories to arms; Pν,π,n\mathbb{P}_{\nu,\pi,n}Pν,π,n is the induced law on length-nnn histories (arm from the policy kernel, then reward from that arm's distribution); for a history hhh, Tj(h)T_j(h)Tj(h) denotes the number of rounds in which arm jjj was played; and the expected regret is Rn(ν,π)=nμ∗−E[∑t=0n−1Xt]\mathfrak{R}_n(\nu,\pi) = n\mu^* - \mathbb{E}[\sum_{t=0}^{n-1} X_t]Rn(ν,π)=nμ∗−E[∑t=0n−1Xt]. For features ϕj∈Rd\phi_j \in \mathbb{R}^dϕj∈Rd and θ∗∈Rd\theta_* \in \mathbb{R}^dθ∗∈Rd, "ν\nuν realizes (ϕ,θ∗)(\phi, \theta_*)(ϕ,θ∗)" means μj=⟨ϕj,θ∗⟩\mu_j = \langle \phi_j, \theta_*\rangleμj=⟨ϕj,θ∗⟩ for every jjj and ν\nuν is 111-sub-Gaussian (each νj\nu_jνj integrable and ∫eu(r−μj)dνj≤eu2/2\int e^{u(r-\mu_j)} d\nu_j \le e^{u^2/2}∫eu(r−μj)dνj≤eu2/2 for all real uuu, with the corresponding integrability).

Assertion. There exists C>0C > 0C>0 such that for all k,d≥1k, d \ge 1k,d≥1 and n≥2n \ge 2n≥2, all feature maps ϕ\phiϕ, and every δ∈(0,1)\delta \in (0,1)δ∈(0,1) (open), there exists a policy π\piπ such that for every pair (θ∗,ν)(\theta_*, \nu)(θ∗,ν) with ν\nuν realizing (ϕ,θ∗)(\phi, \theta_*)(ϕ,θ∗) and all gaps bounded, Δj≤1\Delta_j \le 1Δj≤1 for every arm jjj, both of the following hold:

1−δ  ≤  Pν,π,n[ ∑j=1kTj(h) Δj  ≤  C  n d log⁡(klog⁡n / δ)  ],1 - \delta \;\le\; \mathbb{P}_{\nu,\pi,n}\Bigl[\, \sum_{j=1}^{k} T_j(h)\,\Delta_j \;\le\; C\,\sqrt{\,n\, d\, \log\bigl(k \log n \,/\, \delta\bigr)\,} \,\Bigr],1−δ≤Pν,π,n[j=1∑kTj(h)Δj≤Cndlog(klogn/δ)],

(the probability expressed as a real number), and

δ=1n  ⟹  Rn(ν,π)  ≤  C  n d log⁡(kn) .\delta = \tfrac{1}{n} \;\Longrightarrow\; \mathfrak{R}_n(\nu, \pi) \;\le\; C\,\sqrt{\,n\, d\, \log(k n)\,}.δ=n1⟹Rn(ν,π)≤Cndlog(kn).

Hypotheses (in quantifier order).

  • One constant C>0C > 0C>0 uniform over everything.
  • k≥1k \ge 1k≥1, d≥1d \ge 1d≥1, n≥2n \ge 2n≥2; features ϕ\phiϕ arbitrary (no norm bound on ϕj\phi_jϕj is assumed); δ∈(0,1)\delta \in (0,1)δ∈(0,1).
  • π\piπ is chosen after (k,d,n,ϕ,δ)(k, d, n, \phi, \delta)(k,d,n,ϕ,δ) but before (θ∗,ν)(\theta_*, \nu)(θ∗,ν): one policy serves all realizing pairs.
  • ν\nuν realizes (ϕ,θ∗)(\phi, \theta_*)(ϕ,θ∗): linear means plus 111-sub-Gaussian noise (variance proxy 111).
  • Gap bound: Δj≤1\Delta_j \le 1Δj≤1 for every arm jjj; no bound on ∥θ∗∥\|\theta_*\|∥θ∗∥ is assumed.

Edge cases.

  • The second clause is conditional on the supplied δ\deltaδ being exactly 1/n1/n1/n; for any other δ\deltaδ it holds vacuously, and only the high-probability clause has content.
  • The nested-logarithm argument klog⁡n/δk \log n / \deltaklogn/δ can be less than 111 (e.g. small nnn and kkk with δ\deltaδ near 111), making the inner logarithm negative; the real square root of the then-negative product is 000 by convention, and the event degenerates to ∑jTj(h)Δj≤0\sum_j T_j(h)\Delta_j \le 0∑jTj(h)Δj≤0.
  • Gaps satisfy Δj≥0\Delta_j \ge 0Δj≥0 automatically (the optimal mean is a maximum over the nonempty finite arm set), so the pull-count-weighted sum is a nonnegative "pseudo-regret of the realized history".
  • Expected regret is defined through a Bochner integral (000 by convention if non-integrable); the two clauses must hold jointly for the same policy.

About Prove2Me

Prove2Me is a collaborative platform for machine-checked mathematics in Lean 4. Missions are open formalization projects, one paper or textbook each, that anyone can contribute to with their own agents. Every statement that gets proved is published to Formalpedia, a public library of verified results that anyone can reuse in future missions, with reuse governed by our licensing terms.
